The first step in the Beyer model is Establishing Purpose. When approaching a new problem or situation, it is important to begin by clearly articulating the overall goal or purpose. What is the issue being examined? Why is it important to think critically about this issue? What kind of decision needs to be made or what problem needs to be solved? Having a clear sense of purpose helps guide the rest of the critical thinking process.

The second step is Questioning. Beyer emphasizes that strong critical thinkers ask good questions. Not just any questions will do – the types of questions asked need to match the established purpose and move the thinking process forward in a meaningful way. Effectively questioning involves activities like identifying assumptions, points of view, reasons and claims, alternatives, implications and consequences. Questions also need to be open-minded and aimed at exploring all aspects of the issue.

CAN YOU EXPLAIN HOW THE RANDOM FOREST ALGORITHM WORKS IN THE LOAN DEFAULT PREDICTION MODEL?

Random forest is an ensemble learning algorithm that operates by constructing a multitude of decision trees during training and outputting the class that is the mode of the classes of the individual trees. Random forests correct for decision trees’ tendency to overfit their training set.

The random forest algorithm begins with acquiring a large number of data rows containing information about previous loan applicants and whether they defaulted or repaid their loans. This data is used to train the random forest model. The data would contain features/attributes of the applicants like age, income, existing debt, employment status, credit score etc. as well as the target variable which is whether they defaulted or repaid the loan.

The algorithm randomly samples subsets of this data with replacement, so certain rows may be sampled more than once while some may be left out, to create many different decision trees. For each decision tree, a randomly selected subset of features/attributes are made available for splitting nodes. This introduces randomness into the model and helps reduce overfitting.

Each tree is fully grown with no pruning, and at each node, the best split among the random subset of predictors is used to split the node. The variable and split point that minimize the impurity (like gini index) are chosen.

Impurity measures how often a randomly chosen element from the set would be incorrectly labeled if it was randomly labeled according to the distribution of labels in the subset. Splits with lower impurity are preferred as they divide the data into purer child nodes.

Repeatedly, nodes are split using the randomly selected subset of attributes until the trees are fully grown or until a node cannot be split further. The target variable is predicted for each leaf node and new data points drop down the trees from the root to the leaf nodes according to split rules.

After growing numerous decision trees, which may range from hundreds to thousands of trees, the random forest algorithm aggregates the predictions from all the trees. For classification problems like loan default prediction, it takes the most common class predicted by all the trees as the final class prediction.

For regression problems, it takes the average of the predictions from all the trees as the final prediction. This process of combining predictions from multiple decision trees is called bagging or bootstrapping which reduces variance and helps avoid overfitting. The generalizability of the model increases as more decision trees are added.

The advantage of the random forest algorithm is that it can efficiently perform both classification and regression tasks while being highly tolerant to missing data and outliers. It also gives estimates of what variables are important in the classification or prediction.

Feature/variable importance is calculated by looking at how much worse the model performs without that variable across all the decision trees. Important variables are heavily used for split decisions and removing them degrades prediction accuracy more.

To evaluate the random forest model for loan default prediction, the data is divided into train and test sets, with the model being trained on the train set. It is then applied to the unseen test set to generate predictions. Evaluation metrics like accuracy, precision, recall, F1 score are calculated by comparing the predictions to actual outcomes in the test set.

If these metrics indicate good performance, the random forest model has learned the complex patterns in the data well and can be used confidently for predicting loan defaults of new applicants. Its robustness comes from averaging predictions across many decision trees, preventing overfitting and improving generalization ability.

HOW DO YOU PLAN TO EVALUATE THE ACCURACY OF YOUR DEMAND FORECASTING MODEL?

To properly evaluate the accuracy of a demand forecasting model, it is important to use reliable and standard evaluation metrics, incorporate multiple time horizons into the analysis, compare the model’s forecasts to naive benchmarks, test the model on both training and holdout validation datasets, and continuously refine the model based on accuracy results over time.

Some key evaluation metrics that should be calculated include mean absolute percentage error (MAPE), mean absolute deviation (MAD), and root mean squared error (RMSE). These metrics provide a sense of the average error and deviation between the model’s forecasts and actual observed demand values. MAPE in particular gives an easy to understand error percentage. Forecast accuracy should be calculated based on multiple time horizons, such as weekly, monthly, and quarterly, to ensure the model can accurately predict demand over different forecast windows.

It is also important to compare the model’s forecast accuracy to some simple benchmark or naive models as a way to establish whether the proposed model actually outperforms simple alternatives. Common benchmarks include seasonal naïve models that forecast based on historical seasonality, or drift models that assume demand will remain flat relative to the previous period. HOW DID YOU MEASURE THE BUSINESS IMPACT OF YOUR MODEL ON CUSTOMER RETENTION?

Customer retention is one of the most important metrics for any business to track, as acquiring new customers can be far more expensive than keeping existing ones satisfied. With the development of our new AI-powered customer service model, one of our primary goals was to see if it could help improve retention rates compared to our previous non-AI systems.

To properly evaluate the model’s impact, we designed a controlled A/B test where half of our customer service interactions were randomly assigned to the AI model, while the other half continued with our old methods. This allowed us to directly compare retention between the two groups while keeping other variables consistent. We tracked retention over a 6 month period to account for both short and longer-term effects.

Some of the specific metrics we measured included:

Monthly churn rates – The percentage of customers who stopped engaging with our business in a given month. Tracking this over time let us see if churn decreased more for the AI group.

Repeat purchase rates – The percentage of past customers who made additional purchases. Higher repeat rates suggest stronger customer loyalty.

Net Promoter Score (NPS) – Customer satisfaction and likelihood to recommend scores provided insights into customer experience improvements.

Reasons for churn/cancellations – Qualitative feedback from customers who stopped helped uncover if the AI changed common complaint areas.

Customer effort score (CES) – A measure of how easy customers found it to get their needs met. Lower effort signals a better experience.

First call/message resolution rates – Did the AI help resolve more inquiries in the initial contact versus additional follow ups required?

Average handling time per inquiry – Faster resolutions free up capacity and improve perceived agent efficiency.

To analyze the results, we performed multivariate time series analysis to account for seasonality and other time based factors. We also conducted logistic and linear regressions to isolate the independent impact of the AI while controlling for things like customer demographics.

The initial results were very promising. Over the first 3 months, monthly churn for the AI group was 8% lower on average compared to the control. Repeat purchase rates also saw a small but statistically significant lift of 2-3% each month.

Qualitatively, customer feedback revealed the AI handled common questions more quickly and comprehensively. It could leverage its vast knowledge base to find answers the first agent may have missed. CES and first contact resolution rates mirrored this trend, coming in 10-15% better for AI-assisted inquiries.

After 6 months, the cumulative impact on retention was clear. The percentage of original AI customers who remained active clients was 5% higher than those in the control group. Extrapolating this to our full customer base, that translates to retaining hundreds of additional customers each month.

Some questions remained. We noticed the gap between the groups began to narrow after the initial 3 months. To better understand this, we analyzed individual customer longitudinal data. What we found was the initial AI “wow factor” started to wear off over repeated exposures. Customers became accustomed to the enhanced experience and it no longer stood out as much.

This reinforced the need to continuously update and enhance the AI model. By expanding its capabilities, personalizing responses more, and incorporating ongoing customer feedback, we could maintain that “newness” effect and keep customers surprised and delighted. It also highlighted how critical the human agents remained – they needed to leverage the insights from AI but still showcase empathy, problem solving skills, and personal touches to form lasting relationships.

In subsequent tests, we integrated the AI more deeply into our broader customer journey – from acquisition to ongoing support to advocacy. This yielded even greater retention gains of 7-10% after a year. The model was truly becoming a strategic asset able to understand customers holistically and enhance their end-to-end experience.

By carefully measuring key customer retention metrics through controlled experiments, we were able to definitively prove our AI model improved loyalty and decreased churn versus our past approaches. Some initial effects faded over time, but through continuous learning and smarter integration, the technology became a long term driver of higher retention, increased lifetime customer value, and overall business growth. Its impact far outweighed the investment required to deploy such a solution.
